Experimental multi-GPU mini-framework for Theano

It supports data-parallelism inside one compute node, not model-parallelism. For model-parallelism check Theano multiple GPUs tutorial.

In Platoon, there are two main components : workers, and controllers. Workers do the bulk of the work (training, monitoring, ...). Controllers interact with multiple workers to coordinate their work, collect the results and decide how to act on them. To use Platoon, you will need to write code which uses a worker. You can also extend the functionality of a worker or a controller by implementing your own. Platoon provides helper classes to facilitate this.

This framework is under development. Its interface is not polished and it is likely to undergo changes in the future.

The framework provides two separate worker interfaces that allow user to implement multiple data-parallel algorithms: param_sync and all_reduce. The default interface is param_sync. Installing optional dependencies listed in the features table below will make all_reduce interface available too.

There are currently two algorithms for distributed gradient descent implemented with param_sync interface and three with all_reduce interface.

  • param_sync: EASGD and ASGD.
  • all_reduce: Synchronous sum/average SGD, EASGD and a synchronous variant of Downpour

There are working examples in the examples directory.

The steps below describe what needs to be done to use Platoon for data-parallelism. The LSTM example in the folder 'example' was implemented following these steps and should be referred to for guidance.

Install

You can simply install it using pip. pip install git+https://github.com/mila-udem/platoon

If you would like to use the examples or help develop platoon first you have to clone the repo.

git clone https://github.com/mila-udem/platoon

Then install what you just cloned.

pip install -e <path-to-platoon-folder>

Usage

The simplest way to launch a multi-gpu experiment is to first implement a controller and a worker as described below and then launch it using the platoon-launcher. It is not necessary that you have implemented a controller file if you want to use the existing controller functionality.

The launcher assume that you named both files as such: <experiment-name>_controller.py and <experiment-name>_worker.py.

Then to launch the experiment you just need to specify the experiment name and GPUs you want to use:

platoon-launcher <experiment-name> -D gpu0 gpu1

You can also omit the -D argument and let launcher find all available CUDA GPUs to use in the single-node experiment:

platoon-launcher <experiment-name>

Implementing a controller

These steps describe how to implement the Python script that will launch your controller. In the included LSTM example, both of these steps are done in the file lstm_controller.py

  1. Define which commands your controller can receive and how it responds to them. Commands starting by "platoon-" are reserved by platoon.

This is done by creating a new class that inherits from channel.Controller and having it override the method handle_control() which will be called whenever your controller receives a request from a worker.

  1. Instantiate and launch your custom controller.

Create a script that will instantiate your custom controller. Once this is done, define the port on which the controller should listen by calling the function init_control. Finally, call your controller's serve method which will make him ready to receive requests from workers.

Implementing the workers

These steps describe how to start with a script that performs stand-alone training of a machine learning model and adapt it to serve as a worker in Platoon.

  1. Add a new parameter to the script which will be used during execution to know whether the worker is the first one to be launched and should create the central parameters or not.

  2. Before entering the main loop, the script must create an instance of the class channel.Worker, providing it with the same port number as used to initialize the controller. It is not necessary to sub-class Worker, you can instantiate it directly. This object will provide the necessary methods to handle communication with the controller.

  3. After the model has been built and the parameters initialized, initialize the central parameters by calling the Worker's init_shared_params() method. Every worker should call this method.

  4. In the main loop, instead of deciding when to train and when to monitor performance, the worker should send control request to the controller to know what action it should take, according to the communication protocol established in the controller's handle_control() method.

  5. In the main loop, whenever the worker has performed N (a hyper-parameter) iterations of training, it should synchronize it's parameters with the central parameters using it's Worker's sync_params() method.

Real usage consideration

The optimal (as in more efficient for learning) hyper-parameters values are dependent on the number of workers. At least, consider tuning the learning rate and the alpha parameter of EASGD.

How to change the alpha hyper-parameter isn't clear. An alpha of 0.5 for the LSTM example with 2 workers seem to have good training efficiency for this model/dataset/hyper-parameter combination.

Using alpha = 1/N (with N being the number of workers) might be a reasonable guideline but the experiments performed with Platoon are insufficient to conclude anything.

In the EASGD paper it is shown that in some cases a larger number of workers can result in a better test error.

Debug workers

Currently, the pdb debugger cannot be used on worker processes, because the main console running the controller process is not connected to the worker prompt.

Debugging models would be easier if we could pass the worker's pdb prompts to the main terminal.

The Lieutenant never terminate, this will cause problems when running on a cluster.

This will cause problems on clusters in the sense that your job will not finish when it's done but always be killed at the end of your walltime.

One solution would be to modify the Soldiers so that it always send their PID with the request and modify the handle_control function in the Lieutenant so it takes another argument (workerID).

This way then the user implement a Lieutenant they will have the opportunity to keep track of the worker and shutdown when there is no more active worker.

We should also modify the LSTM example to consider this.

synchronization costs lots of time when multiple processes are doing it at the same time

Hi all,

I have noticed that the synchronization costs lots of time when multiple processes are doing it at the same time. Usually one synchronization costs about 2-4 secs. But it could be over 100 seconds when over 1 processes are doing it. Then all the processes are all waiting there (only one process is training).

I tried to avoid multiple processes synchronizing its parameters at the same time using the following code. Basically when one worker wants to synchronize its parameter, it will send a message to the server and check whether there is another worker doing it. However, it does not work. I have checked the code a few times and I think it should be able to solve the problem. Any idea why it does not work as expected? Thanks a lot.

In summary, two issues,
1, Why synchronization costs lots of time when multiple processes are doing it at the same time. (Probably waiting for the lock, but it takes much more time than needed.)
2, How to make sure only one worker synchronize its parameters at one time?

Valid command do not valid with master weights and cause expired local weights

  • If a worker receive a valid command, he will do validation with the current local weights. I would expect him to do so with the master weights.
  • After the valid command, is the worker receive a train or another valid command, he will continue to use a old "expired" local weights. If this is bad or not isn't clear. I think it is bad, other people aren't as sure. We should test it or at least provide a way to let people test both options.

Exaggerated time cost when building/ compiling theano functions

I was using the newest version of platoon, and newest version of theano to build a multi-node neural machine translation system.
I implemented the controller and worker on two different platoon version, platoon.0.5 (around july 2016) and platoon-0.6 (current version), respectively.

But the compiling time for theano functions varies. The compiling time of second version is multiple times of the first one. I didn't record the time accurately, but the time cost difference is remarkable.

I'm wondering why did this happen. I'm not sure whether it's a bug or my wrong implementation for the second version.

implementation info to help

  1. for the old version. I implemented a controller and a worker. In this version, we should start a controller, then start multiple workers (I'm pretty sure this implementation is correct).
  2. for the new version. I implemented a controller and a worker, too. But we only need to set all the parameters first, then start a controller. Then the controller will start workers automatically (I'm not very sure about the correctness of this version)..

LSTM example : copy params locally before entering main loop

Currently, the model gets the latest parameters and then compiles the theano function and enters the main loop. If the compilation takes too long, by the time it starts training, the parameters will be outdated.

It applies a bit less to the LSTM example since its compilation time is very reasonnable but since many people will simply copy paste from the example, it would be a good thing for this example to copy the params locally just before entering the main loop. (some students faces that issue when trying to adapt the lstm example to their huge models which can take >30 minutes to compile)

platoon_launcher vs platoon-launcher

Can I suggest platoon-launcher as the name of the executable (dash rather than underscore)? The underscore is necessary for modules because of the operator. For command-line stuff, the extra shift is annoying to type. This also keeps consistency with blocks-continue, fuel-convert, etc.

Generate site for documenting Platoon and coding standards

I think there should be an effort to rewrite some documentation (e.g. instructions) for Platoon and generate files to have an official reference site, such the ones there are for Theano or Blocks.

I propose using readthedocs for this purpose. I will begin writing detailed instructions on how to use the new interface of Platoon soon.

Also, I propose imposing the same standards as the ones in Blocks.

The program just stops. It seems that the problem is with this line "_lock.acquire(timeout)"

After running a few hours, the program just stops. It seems that the problem is with this line "_lock.acquire(timeout)". As shown in "https://github.com/mila-udem/platoon/blob/master/platoon/channel.py#L390", the timeout is "None" as default.

From here (http://semanchuk.com/philip/posix_ipc/), "A timeout of None (the default) implies no time limit. The call will not return until its wait condition is satisfied."
I don't know what the problem is yet.

Anyone has encountered this before?

Platoon doesn't work on Windows

It's probably not a real issue but, Platoon will not work on Windows because we are using posix_ipc which is not compatible and I think the way we use cffi would need some tweaking.

The distributed algorithm I would like to try and implement is EASGD (arXiv:1412.6651), which is beautifully simple (see algorithm 1 in the paper):

In general, distributed algorithms can probabably take the form update_params(shared_params, worker_params), which is a function that is expected to update both in place, so:

"from theano import gpuarray as theanoga" may raise some error.

I fixed this to "from theano.sandbox import gpuarray as theanoga "
and got another warning

Reason: context name None not defined"

I have installed pygpu and nccl.
Could you help me?

The LSTM example runs CPU only

I installed Platoon and tried to run the LSTM example on my 4 GPUs (gpu0...gpu3) Ubuntu server. I followed the example tutorial, hence in the example/lstm directory I run (in separate terminals):

  • $ THEANO_FLAGS='device=cpu' python -u lstm_controller.py
  • $ THEANO_FLAGS='device=gpu2' python -u lstm_worker.py
  • $ THEANO_FLAGS='device=gpu3' python -u lstm_worker.py

The result is that the CPU runs up to 100% and GPUs (according to nvidia-smi) stay still. I tried to force the device by using:

  • $ THEANO_FLAGS='device=gpu2,force_device=True' python -u lstm_worker.py
  • $ THEANO_FLAGS='device=gpu3,force_device=True' python -u lstm_worker.py

But nothing changed. Finally I tried to mask out the first two GPUs in order to make the scripts think they use the first two GPUs:

  • $ CUDA_VISIBLE_DEVICES='2,3' THEANO_FLAGS='device=gpu0,force_device=True' python -u lstm_worker.py
  • $ CUDA_VISIBLE_DEVICES='2,3' THEANO_FLAGS='device=gpu1,force_device=True' python -u lstm_worker.py

But it didn't help either.

What's really weird is the Theano debug output stating "Using gpu device 2: Tesla...." even though the computation clearly runs on CPU only.

Am I doing something wrong or is it some kind of bug? Thanks

LSTM example does not work with synchronous all_reduce interface

The LSTM example fails to finish training with the all_reduce interface. It was made for the asynchronous param_sync interface with workers sending messages asking what to do next and writing to shared memory when told.

With all_reduce, the workers train, and one of them converges and stops, but the other get stuck in its training loop when it tries to calculate f_grad_shared. It might be trying to perform an all_reduce but cannot communicate with workers who have finished.

A suggestion it to rewrite the example from scratch for the synchronous interface. This would involve having workers train together, then wait to validate together, and stop together. Ideally, the validation set would be split between workers.

about initialize in lstm example

In LSTM example, every worker initialized their own parameters with different random seed. This seems to be a bug for all-reduce update: because the elastic force for each worker is based on different central. This may be not so serious for param-sync mode, there for all workers share one unit central memory.

Problem with mini-batches in Controller and fixed nb of mb in Worker before sync.

In the case where the Controller manages the mini-batches but, the Worker decides when to sync with the global parameters, you can encounter the problem where the Worker is waiting for more mini-batches before doing a sync but none is available.

A possible fix for this would be to let the Controller decide when a Worker should sync.

[Launcher] Naming scheme for controller / worker scripts

Currently, platoon_launcher expects two scripts, <expname>_controller.py and <expname>_worker.py to exist.
If we want to have a few generic controllers, rather than one per experiment, it should be possible to explicitly specify the controller script's name, and maybe the worker's script as well.

GPU Memory cost too much with platoon

I write a neural machine translation system with platoon.
The batch size is 80 and sync every 10 mini-batches.
I found that the memory cost about 4 times larger than the same system without platoon.
Does someone else have the same experience?

I have also test the "lstm" example, which cost about 5GB memory with 16 batch size and 1024 hidden size.
Could some else help me to find the problem?

Python 3

The current code isn't compatible with Python 3 at all, which is annoying. I run Python 3 and this causes any project that imports Platoon somewhere to fail immediately.

In general, even if the lab still develops on Python 2, we should at least make sure that the tools don't crash for people who run Python 3. We're going to have to switch someday (sooner rather than later) and legacy Python compatibility is pretty trivial with six most of the time.

Question regarding custom parameter update rule

I have a (probably noob-level) question regarding how ASGD is implemented in Platoon, which I need to understand in order to customized for my needs. If this is not the right place to ask this kind of questions, please let me know. Current implementation is as follows:

How do shared variables local_params and self.old_locals have different values assigned? We create self.old_locals from the values of local_params, so aren't they supposed to be equal? Or is it related to the keyword arguments used (borrow=True, return_internal_type=True)? Am I missing something?

Shouldn't the implementation just add the difference between local and master to master params (as it is done for EASGD)?

My end goal is to have a shared variable (let's say local_params[-1]) that is not a model parameter, and hence it should be updated simply as I described above. That is, replace the old value with the new value. Do you have any suggestions on how to achieve this? My naive attempt was the following code:

Trying to understand why posix_ipc/shared memory is used. Can someone explain why in a bit more details? Thanks!

[Launcher] Print logs from workers and/or controller

The stderr and stdout of workers and controller are redirected to log files, but it would be nice to be able to print them interactively, maybe with a line prefix that identifies from which process the logs are coming.

I think it is because of this line. self._local_id = gpucoll.GpuCommCliqueId(context=self.gpuctx)

I have installed pygpu and nccl already.

Any idea?

What is the status on controller-handled dataset?

The README file of the Batched Pixel Sum example warns:

  • Using more than 1 worker causes problem at the moment for THIS particular example.

The reason is that we are using the "dataset handled by the controller" feature which is not quite ready yet.

I assume this refers to using the Controller send_mb method (which uses a Zeromq load balancer) to distribute the mini batches among Workers.

What is the status on this feature? I'd like to give Platoon a try and this seems like an important block for a data parallelism framework.

error occurred when installed gpuarray

Hi, I was using anaconda2 to install theano and platoon.
When I installed libgpuarray and pygpu successfully, and then tried to run the example 'lstm', the error occurs as following (anyone could help please?):

cannot find command 'platoon-launcher'

I just downloaded this framework, but i failed running the example program. I just run it according to the usage:
platoon-launcher lstm -D gpu0 gpu1,
but it says "cannot find command platoon-launcher", and when i manually run this program, according to:
THEANO_FLAGS='device=cpu' python -u lstm_controller.py,
it says 'lstm_controller.py: error: too few arguments'.
So is there anybody can tell me why?
